Note: This is a review of Srivastava et al. I used several sources such as MIT news to complete this review. In their paper , Srivastava et al. Dropout was the first method to address the issue of overfitting in parametric models. Even today, Dropout remains efficient and works well.

Deep neural networks contain multiple non-linear hidden layers to learn complicated mappings between their inputs and outputs. Due to their large number of parameters, they need huge amounts of training data to avoid overfitting to the sampling noise. To avoid overfitting, several strategies have been proposed such as stopping the training as soon as performance on a validation set starts to get worse, introducing weight penalties, and soft weight sharing [Pre98]. The Bayesian golden standard is to average the predictions of all possible settings of the parameters, weighting each setting by its posterior probability given the training data. Clearly this requires too much computation, so researchers often settle for ensemble methods. However, ensemble methods are merely stop-gaps since large networks are just as costly to evaluate. One recent idea to reduce overfitting is to regularize a neural network with noise.

Deep learning neural networks are likely to quickly overfit a training dataset with few examples. Ensembles of neural networks with different model configurations are known to reduce overfitting, but require the additional computational expense of training and maintaining multiple models. A single model can be used to simulate having a large number of different network architectures by randomly dropping out nodes during training. This is called dropout and offers a very computationally cheap and remarkably effective regularization method to reduce overfitting and improve generalization error in deep neural networks of all kinds. However, many of the modern advancements in neural networks have been a result of stacking many hidden layers. This deep stacking allows us to learn more complex relationships in the data. In this post, I'll discuss common techniques to leverage the power of deep neural networks without falling prey to overfitting. Arguably, the simplest technique to avoid overfitting is to watch a validation curve while training and stop updating the weights once your validation error starts increasing. Reminder: During each iteration of training, we perform forward propagation to compute the outputs and backward propagation to compute the errors; one complete iteration over all of the training data is known as an epoch.
